However, they face key limitations, including dependency on large, high-quality datasets, difficulty adapting to dynamic environments, and limited interpretability in high-stakes scenarios.

The study emphasizes that while ML and DL improve UAV sensing and control, they often lack the robustness required in complex or adversarial contexts. For instance, ML-based intrusion detection systems can fail under adversarial attacks or when data is sparse. DL models, although capable in controlled scenarios, struggle with generalizability when drone missions vary drastically in purpose, environment, and conditions.

These models, including GPT-4, Claude 3.5, and LLaMA3, offer improved reasoning, contextual understanding, and natural language interaction capabilities. When embedded in UAV systems, LLMs facilitate real-time decision-making, interpret voice or text commands, and support autonomous responses to unforeseen challenges.

The integration of LLMs also improves tasks such as battery monitoring, flight path generation, authentication, encryption, and emergency protocol design. For example, LLMs can synthesize flight logs, laws, and training manuals to conduct safety audits or create compliance reports. What are the challenges and future directions for LLMs in UAV systems?

Despite their potential, the deployment of LLMs in UAVs faces significant technical challenges. First is latency. Real-time UAV applications, such as obstacle avoidance or tactical coordination, require processing speeds often beyond the capabilities of current LLMs, especially when deployed on resource-constrained onboard hardware. Privacy and regulatory compliance also remain critical concerns. LLMs trained on open datasets risk inadvertently exposing sensitive operational details or failing to align with aviation cybersecurity standards. Ensuring data protection and ethical deployment will require a combination of encryption, federated learning, and secure APIs.

To address these issues, the paper calls for future research into:

  • Multimodal embodied intelligence, allowing LLMs to fuse data from multiple sensors and contextual inputs;
  • Decentralized swarm AI coordination, for greater redundancy and fault tolerance;
  • Lightweight adaptive models, tailored for onboard processing;
  • Regulatory frameworks that harmonize AI deployment in UAVs with international airspace management laws.
